Awesome ML Data Quality Papers

This is a list of papers about training data quality management for ML models.

Introduction

Data quality is fundamental to machine learning (ML) tasks. Traditionally, it was measured by predefined rules such as completeness and consistency. With the rise of Data-Centric AI, the focus has shifted toward the dynamic value of data: how individual or groups of samples influence model behavior. This influence extends beyond conventional metrics like accuracy and MSE to broader concerns such as fairness and robustness. We refer to this line of research as Data Attribution (DA). Building on this, Data Sculpting (DS)[1] has emerged as another core research direction: given massive datasets, how do we curate the most valuable set of data for model training or inference, improving model performance or efficiency?

Specifically, DA covers topics such as data attribution, data valuation, data debugging, sample-based explanation, etc. DS covers data selection, data pruning, coreset selection, data curation, etc.

This repository collects and organizes papers on DA and DS, ordered chronologically, to help researchers quickly navigate the landscape and track the latest advances in the field.
